When I was about 10, 65 years ago, I began my stamp collection. I think I bought the big orange bag at Kresge's. I LePage glued all the used stamps into my album AND LICKED all the mint ones......until I ran into a big purple Monaco stamp (It's still sitting in front of me right now). I licked it and the glue tasted so bad, I can remember it today. I guess I learned about stamp hinges after that. :)
I got most of the stamps of the paper from the albums but I have a few that they must have used crazy glue I just can't get them of the paper. Lucky most are off. Luckily most of my stamps were hinged and not glued. So wish they didn't hinge them though but back then everyone was doing that. the books recommended it. I have books from the 1940's and it say to hinge them in the book albums. Now it is NOT recommended. Mint is best but my family collected cancelled stamps so they were not mint to begin with. I need help so bad I am in the same boat with this. I just can't get help from anyone. Most people don't collect stamps. So greatly appreciated so very much. I hope I can pay it forward some how in the future and help others too. I tried water it did not work. Not even a budge. I soaked mine for two days to try again and not a budge again so I gave up. I lay mine upside down to dry so they don't stick to the towel. Then when dry I put them in a big book and put many others books on top for weight so they will be nice and flat. When you have thousands this takes a very long time. I had to leave mine on the paper also.
Have you tried benzine[leather cleaning] etc. depends on the glue that the collector used whether UHU or wood glue. Which is a shame on the mint stamps.
What about the lighter fluid and other chemicals used for removing self adhesive stamps? If your glue is not water soluble, some of these might work? Or am I totally off the track?
What are Elmers glue sticks made of? Like most glues, Elmer's ingredients mainly consist of a type of thermoplastic (PVA), water, ethanol, and acetate.

Acetone will soften super glue but--likely will damage the ink on the stamps. Worth a try though, as you have nothing to lose.

You might try soaking in very hot to boiling water. That might work where normal water temperature does not.

What about “adhesive remover”, “goo gone” or some type of chemical remover formula? Don’t give up yet…
If you are soaking off a lot of stamps I use newspaper to dry them. I just put one page between each stamp layer.

Soaking won't work with glue, why don't you try benzene or isopropyl alcohol?

It was likely PVA glue. I’d leave it soaking for a few days and check, then keep repeating…
